Debate-augmented weak supervision¶
Definition¶
Debate-augmented weak supervision is a hybrid alignment technique that combines scalable oversight with weak-to-strong generalization: before a weak supervisor produces training labels for a strong student, two instances of the strong model debate opposing answers to each question, and the debate transcript is appended to the weak model's training inputs — letting the weak supervisor extract trustworthy signal from a capable but untrustworthy model on the principle that it is harder to lie than to refute a lie.
Explanation¶
The pipeline (arXiv 2501.13124, a research paper on open Qwen models) has three steps: two strong-model instances are randomly assigned opposing answers and argue for three turns; an ensemble of weak models is finetuned on ground-truth labels with the transcripts appended to each sample; and the strong student is finetuned on the ensemble's averaged soft labels. Debate helps because a debater arguing a falsehood exposes flaws its opponent can convincingly point out, so the transcript carries the merits and flaws of both sides in a form a small model can exploit as context. Ensembling matters because three-turn transcripts are long relative to weak-model capacity: four-member ensembles whose members differ in the debate sampling seed consistently beat both single weak models and ensembles differing only in finetuning seed, meaning transcript diversity — not finetune noise — is the useful variance. On the OpenAI weak-to-strong NLP benchmarks (SciQ, BoolQ, CosmosQA, AnthropicHH; Qwen-7B weak, Qwen-14B strong) the method raised performance-gap-recovered well above the auxiliary-confidence-loss baseline, for example 41.2% to 76.5% on SciQ, and beat the consultancy and market-making alternatives in ablation. Extending debate past three turns hurt — debaters lost the thread of long transcripts. The paper's own caveats: the 7B-versus-14B capability gap is modest, and the procedure is expensive, needing two debaters and multiple turns per sample.
